Abstract

This paper presents the architecture, design, and experimental evaluation of an intelligent conversational AI chatbot developed using advanced Natural Language Processing (NLP) techniques and Machine Learning (ML) algorithms. The proposed system integrates a transformer-based deep learning backbone with intent classification, named entity recognition, contextual dialogue management, and a retrieval-augmented generation (RAG) pipeline. The chatbot achieves a BLEU-4 score of 0.73, intent recognition accuracy of 94.2%, and an average response latency of 212 ms on benchmark datasets. Experimental results demonstrate substantial improvements over rule-based and traditional ML baselines, with particular gains in multi-turn contextual coherence and out-of-vocabulary handling. The system is evaluated on three domain-specific corpora: customer service, healthcare enquiries, and educational assistance. Ablation studies validate the contribution of each architectural component. The findings confirm that transformer-based NLP pipelines with RAG substantially elevate chatbot performance in real-world deployments.

Full Article/Conclusion

This paper has presented ICAB-RAG, a modular intelligent conversational AI chatbot system integrating fine-tuned BERT-based intent classification, BiLSTM-CRF named entity recognition, a hybrid DFA-RL dialogue manager, and a retrieval-augmented GPT-2 response generator. Extensive evaluation on three domain-specific corpora demonstrates state-of-the-art performance: 94.2% intent accuracy, 88.6% NER F1, BLEU-4 of 0.73, and mean human evaluation scores exceeding 4.0/5.0 across coherence, informativeness, and naturalness. Ablation studies confirm the indispensable role of retrieval augmentation in response quality. Future research directions include: (1) multilingual extension via mBERT or XLM-RoBERTa; (2) continual learning mechanisms for dynamic knowledge base updates; (3) integration of multimodal inputs (images, audio) for richer conversational contexts; (4) few-shot domain adaptation to minimize annotation overhead for new deployment domains; and (5) adversarial robustness training to improve resilience against prompt injection and jailbreaking attempts. The ICAB-RAG system demonstrates the viability of combining structured NLP pipelines with neural generation for production-grade conversational AI. The modular architecture ensures maintainability and facilitates targeted improvements without full system retraining, positioning it as a robust foundation for enterprise-scale intelligent virtual assistant deployments.
